Lesson 86 — Intermediate
Model Evaluations & Benchmarking
Model evaluations mein tum foundation model ki core capability measure karte ho — knowledge, reasoning, coding — bina apne application ka wrapper lagaye. Public benchmarks isi kaam ke standard tools hain, par har benchmark ka apna mechanism hai aur har leaderboard ka apna dhoka. Is lesson mein hum dekhenge ki benchmark banta kaise hai, capabilities kaise measure hoti hain, aur score padhte waqt kya-kya cross-check karna chahiye.
Benchmark kya hai
WHAT
Benchmark ek standardized test set hai jisme fixed dataset, fixed prompts, defined scoring method aur defined aggregation hoti hai — taaki koi bhi model usi scale pe compare ho sake. Ek benchmark = ek specific capability ka controlled measurement.
WHEN
Foundation model choose karte waqt (shortlist banane ke liye), naye model launch pe capability check karne ke liye, aur research mein "kitni progress hui" jaanne ke liye. Tumhare app ka final decision phir bhi custom eval se hota hai.
WHERE
Public leaderboards pe (jahan providers apne models ka score submit karte hain), research papers mein, aur apni internal model comparison mein (jab tum khud ka benchmark bana kar models ko rank karte ho).
Yaad rakho: benchmark ek proxy hai. Wo batata hai "is model ki is capability ka level kya hai duniya mein" — par tumhara use-case us capability ka ek alag slice ho sakta hai. Benchmark ko orientation ke liye use karo, judgment ke liye nahi.
Core LLM capabilities — kya measure hota hai
- Knowledge: kya model world ke facts jaanta hai — exams-style multiple choice se test hota hai (jaise MMLU family).
- Reasoning: multi-step logic, patterns, deductions — math word problems aur logic puzzles se.
- Mathematics: calculation + word problems — proof aur numerical accuracy ke saath.
- Coding: function generation, debugging, code comprehension — automated tests se verify hota hai (code chal kar dekhte hain, judge se nahi).
- Instruction following: kya model exact format/constraint follow karta hai — "sirf JSON do, koi extra text nahi".
- Long-context understanding: lambi document mein se relevant info nikalna — needle-in-haystack se lekar multi-doc reasoning tak.
- Multimodal: image + text, audio, video understanding.
- Safety: harmful requests refuse, bias control, jailbreak resistance.
- Tool use / agentic: sahi tool choose karna, arguments bharna, multi-step plans follow karna.
Benchmark anatomy — 5 components
1. DATASET — questions/inputs (kahan se aaye, kitne examples, kya format)
2. PROMPTS — exact prompt template jo har input ke saath lagta hai
3. RUN CONFIG — model version, temperature, max tokens, few-shot count, CoT ya direct
4. SCORING — exact match / multiple choice accuracy / pass@k (code tests) / judge
5. AGGREGATION — overall score kaise banta hai (category weights, partial credits)
# Score ko tabhi samjho jab ye paanchon pata hon:
# "MMLU 80%" ka matlab hai "is exact prompt+config pe, MCQ accuracy 80%" —
# config badal do toh score bhi badal jaayega, model same rahega bhi.
- Prompt sensitivity: benchmark ka official prompt template use karo agar comparison chahiye. Tumhara custom prompt score alag la sakta hai — galat comparison mat karo.
- pass@k mechanism: coding benchmarks mein k sample generate karte hain, aur agar unmein se koi bhi ek tests pass kar gaya toh pass. Isliye pass@1 (ekdum strict) aur pass@10 (generous) alag numbers hote hain.
- Aggregation dhoka deta hai: overall score strong categories mein chhup sakta hai. Ek model overall barabar hai par safety mein bahut peeche — category breakdown padho.
Public leaderboards aur unke pitfalls
Public leaderboard pe providers apne model ke benchmark results submit karte hain — community leaderboard models ko rank karta hai. Yeh useful hai shortlist banane ke liye, par har score ke peeche ek story hai jo tumhe check karni chahiye.
- Data contamination: agar benchmark ka dataset public hai, toh wo training data mein aa sakta hai — model ne questions rat liye. Score high, learning zero. Fresh/private test sets isi liye bante hain.
- Score saturation: top models ek benchmark pe lagbhag maximum score tak pahunch jaate hain — ab wo test unhe distinguish nahi kar paata. Isliye harder benchmarks aate rehte hain.
- Benchmark overfitting: providers models ko benchmark-style data pe train kar sakte hain — score badhta hai, real-world performance us hisaab se nahi.
- Configuration gaming: temperature, few-shot examples, test-time tricks — config badal kar score tweak ho sakta hai. Unfair comparison ka sabse aasaan tareeka yahi hai.
Exercise
Question: Coding benchmarks mein model ke code ko kaise verify kiya jaata hai — judge se ya actual tests chala kar?
Question: Agar benchmark ka dataset model ki training data mein aa gaya ho, toh us problem ko kya kehte hain?
Question: pass@1 aur pass@10 mein se kaunsa score zyada strict hai?
Question: Top models ke scores jab ek benchmark pe lagbhag maximum tak pahunch jaate hain, toh us phenomenon ko kya kehte hain?
Common mistakes
- Leaderboard score ko apne app ki guarantee samajhna: — benchmark general capability ka proxy hai. Tumhare domain ke jargon, apne format aur apne rules ke saath app alag perform kar sakta hai — final decision custom eval se lo.
- Bina configuration ke scores compare karna: — prompt style, few-shot count, temperature sab score badlate hain. Do numbers tabhi comparable hain jab run config same ho.
- Overall score dekh kar category weakness chhup jaana: — average strong reasoning se hide ho sakti hai weak safety ya formatting. Category breakdown hamesha padho.
- Purane benchmark ka score aaj bhi utna maanna: — saturation hone ke baad wo test naye models ko distinguish hi nahi karta. Har benchmark ki "abhi kitna informative hai" poochho.
Har coaching ka apna mock test hai — kisi ka test aasaan (sabko high score), kisi ka tough. Aur agar paper ka question bank leak ho jaaye toh topper wahi hai jisne rat liya tha — benchmark bhi yahi teen problems dikhati hai:
# Benchmark ka score tabhi samjho jab 3 cheezein saath hon:
benchmark = {
"dataset": "kahan se questions (public? fresh? private?)",
"config": "prompt template + temperature + few-shot count",
"metric": "accuracy ya pass@k — definition kya hai",
}
# Rank dekh kar decision mat lo — pehle yeh 3 cheezein verify karo,
# phir apne task ke custom eval pe final rakho.- Q: Benchmark ke 5 components batao aur batao score ko validate kaise karoge.
- Q: Data contamination kya hai? Isse benchmark ki reliability kaise kharab hoti hai?
- Q: pass@1 aur pass@10 mein farq samjhao — kis scenario mein kaunsa meaningful hai?
- Q: Benchmark saturation aur overfitting mein farq? Provider perspective se batao.
- Q: Public leaderboard aur tumhara internal custom eval — kab kaunsa use karte ho?
